A CI pipeline turns red. A developer opens the logs, searches for the error, checks the code, and starts investigating.

Sometimes the problem is obvious. Other times, the same failure has appeared before, someone has already investigated it, and the team is repeating work that should not have been necessary.

This is one of the frustrating parts of software development: debugging knowledge is often temporary. A developer may discover the actual cause of a failure, fix it, and move on. Weeks later, another developer encounters a similar problem but has no easy way to retrieve the previous investigation.

We explored this problem while building FlakeTrail, a debugging assistant that uses Hindsight to remember previous CI investigations and retrieve relevant knowledge when similar failures occur.

Why CI failures are difficult to investigate

Continuous Integration (CI) systems automatically build and test software after code changes. They help teams identify problems before changes are merged.

However, a failed test does not automatically explain its cause.

Consider a test that produces this error:

FAILED tests/test_payment.py::test_payment_retry

TimeoutError: payment gateway response exceeded 30 seconds

There are several possible explanations:

The application contains an actual bug.

The test environment is slow.

The payment gateway mock is not responding.

Two tests are interfering with each other.

A dependency or configuration has changed.

The test has a race condition.

The error message identifies a symptom. A developer still needs to investigate the underlying cause.

This creates a repeated workflow: inspect the logs, form hypotheses, reproduce the failure, test possible solutions, and verify whether the problem is resolved.

The difficulty becomes greater when the same type of failure returns.

The hidden problem: debugging knowledge gets lost

Imagine that a developer spends two hours investigating a timeout.

They try increasing the timeout, but the test continues to fail. Eventually, they discover that multiple tests share state through a mock service. They isolate the mock state, rerun the tests, and confirm that the fix works.

The investigation is complete.

But what happens to that knowledge?

It might remain in a pull request discussion, a chat conversation, a personal note, or the developer's memory.

A month later, another developer encounters a similar timeout.

The new developer may repeat the same unsuccessful experiment because the earlier investigation is difficult to find.

The problem is not simply that CI logs are difficult to read. The deeper problem is that the reasoning behind previous debugging decisions is not consistently preserved and reused.

Why another chatbot is not enough

A developer can paste a CI log into a general-purpose AI chatbot and ask for debugging suggestions.

This can be useful, but a new conversation usually lacks the complete history of the team's previous investigations.

A typical chatbot may explain what a timeout means and suggest increasing the timeout. However, it may not know that the team already tried that approach and confirmed that it did not solve the problem.

This distinction matters.

A useful debugging assistant should understand not only the current error but also what happened when the team investigated similar failures previously.

That is the problem we wanted to address with FlakeTrail.

Introducing FlakeTrail

FlakeTrail is an AI-powered CI failure investigation assistant built around persistent memory.

Its central idea is straightforward:

Remember previous debugging investigations so developers can reuse historical knowledge instead of repeatedly starting from zero.

We use Hindsight as the persistent memory layer.

Rather than treating an uploaded log as a completed solution, FlakeTrail distinguishes between the original failure, investigation attempts, and confirmed outcomes.

The system focuses on three operations.

RETAIN — Remember investigation outcomes

When a developer records an investigation result, FlakeTrail stores the relevant information in Hindsight.

This can include:

The failure signature.

The test name.

The error information.

Relevant environment details.

The investigation attempt.

Whether the attempt failed or passed.

Whether a successful change was merged.

Sensitive information is redacted before information is sent to the memory system.

An untested AI suggestion is not treated as a confirmed solution.

We use four statuses:

"proposed"

"failed"

"passed_unmerged"

"verified"

A solution is considered a confirmed fix only when CI passes and the change is merged. This rule is enforced by the backend.

RECALL — Retrieve similar investigations

When a new CI failure arrives, FlakeTrail extracts relevant information and generates a failure signature.

It then queries Hindsight for similar historical investigations.

For example, a new payment test timeout may retrieve an earlier investigation involving a payment gateway mock.

The developer can then see what was previously investigated, which approaches failed, and which solutions were verified.

For normal analysis, our implementation limits retrieval to a maximum of five historical memories.

REFLECT — Reason over historical memory

Hindsight also provides REFLECT, which generates an answer using stored memories as context.

This operation is available as an optional feature in FlakeTrail rather than being called automatically during every analysis.

This separation helps control cloud usage while preserving the ability to ask more detailed questions about historical investigations.

A practical example

Suppose a payment test fails because it cannot receive a response from a gateway mock within the expected time.

During the first investigation, a developer increases the timeout. The test still fails.

The developer then discovers that the mock retains shared state between tests. After correcting the test setup, CI passes and the change is merged.

FlakeTrail records both attempts:

Attempt 1: Increasing the timeout did not resolve the failure.

Attempt 2: Resetting the mock state resolved the issue and was verified after CI passed and the change was merged.

Later, a different payment test experiences a similar timeout.

Instead of starting from zero, FlakeTrail retrieves the earlier investigation.

The developer sees that increasing the timeout was unsuccessful in the previous case and that resetting shared mock state was a verified solution.

The developer can investigate whether the same issue exists in the new test.

FlakeTrail does not automatically assume the old solution is correct. It provides historical evidence that the developer can evaluate and verify.

This is where persistent memory becomes useful.

The technology behind FlakeTrail

Our implementation uses:

React and Vite for the frontend.

TypeScript and Node.js for backend development.

Express for API handling.

Hindsight for persistent investigation memory.

Zod for input validation.

Vitest for automated testing.

The application separates the responsibilities of parsing CI logs, retrieving historical investigations, generating recommendations, and recording outcomes.

We also included secret redaction and backend validation to prevent unverified suggestions from being presented as confirmed fixes.

What we learned

Building FlakeTrail changed how we think about debugging assistants.

A helpful AI system should not simply produce another explanation of an error. It should be able to connect the current problem to relevant historical experiences.

Memory is especially valuable when a workflow repeats, when different developers investigate similar issues, and when previous experiments contain information that should not be lost.

At the same time, memory must be trustworthy. A failed experiment should remain distinguishable from a verified solution. A relevant historical result should not automatically be treated as the correct explanation for a new failure.

These distinctions are important when building software that developers may rely on during real debugging work.

Conclusion

Recurring CI failures are not just a problem of reading error messages. They are also a problem of preserving and retrieving engineering knowledge.

FlakeTrail explores how persistent memory can help developers reuse previous investigation outcomes and avoid repeating unsuccessful experiments.

With Hindsight, we can build a system that remembers more than an error message: it can preserve what was investigated, what failed, and what was eventually verified.

The goal is not to replace developers or automatically fix every failing test.

It is to help developers start their next investigation with better historical context.
