Why Hindsight Needs Evidence Before Suggesting CI Fixes

Two CI failures can display almost identical error messages and still have different root causes.

One timeout might be caused by a slow network dependency. Another might be caused by shared test state. If an AI assistant sees the same error text and immediately recommends the same fix, it could send a developer in the wrong direction.

That is why FlakeTrail does not treat debugging as simply generating an answer from a log. Its reasoning workflow considers the current failure alongside historical investigations retrieved through Hindsight.

The goal is to give developers useful context: what was previously attempted, which approaches failed, which fixes were verified, and what still needs investigation.

The problem with recommendations without history

A typical debugging interaction starts with a developer pasting a CI error into an AI assistant. The assistant reads the message and suggests possible causes.

This can be useful, but the assistant may not know that another developer already tried increasing the timeout and that the change failed. It may also miss a previous fix that passed CI and was merged successfully.

The problem is not that the assistant cannot understand the current log. It is that the investigation history is missing.

FlakeTrail addresses this by retrieving historical investigations before producing its analysis. Hindsight provides the memory layer, while the reasoning module uses the returned records to shape its recommendations.

Step 1: Give the reasoning layer two inputs

The reasoning module receives two main pieces of information:

"parsedFailure": the current test name, error message, failure signature, and other extracted details.

"historicalInvestigations": related investigation records retrieved through Hindsight.

The interface makes this separation explicit:

export interface ReasoningInput {
parsedFailure: ParsedFailure;
historicalInvestigations: HistoricalInvestigation[];
}

This matters because the current error and historical experience answer different questions.

The parsed failure describes what is happening now. Historical investigations describe what happened when related failures were investigated previously.

Combining them gives the application more context than either source provides alone.

Step 2: Separate verified fixes from failed attempts

FlakeTrail uses outcome statuses to distinguish the quality of historical evidence.

A "verified" investigation means CI passed and the change was merged. A "failed" investigation records an approach that did not solve the issue. A "passed_unmerged" investigation means CI passed, but the change has not been merged. A "proposed" status represents an unconfirmed hypothesis.

The reasoning module separates these records before constructing its response:

const verifiedApproaches = historicalInvestigations.filter(
(i) => i.status === 'verified'
);

const failedApproaches = historicalInvestigations.filter(
(i) => i.status === 'failed'
);

const passedUnmerged = historicalInvestigations.filter(
(i) => i.status === 'passed_unmerged'
);

This is a simple but important decision.

A failed workaround should not be presented as a successful fix. A change that passed CI but was never merged should not be treated as a fully confirmed solution either.

The reasoning layer keeps those outcomes separate so that recommendations can reflect what actually happened during earlier investigations.

Step 3: Make recommendations depend on available evidence

The current reasoning implementation follows different paths depending on the historical records it receives.

When a verified approach exists: It highlights the previously verified approach and provides its available pull-request reference. It assigns a high confidence label, while still reminding developers to verify the change in CI.

When previous attempts failed: It identifies the failed approaches and recommends avoiding the same unsuccessful attempts. The confidence label is medium because there is historical information, but no verified fix.

When a change passed CI but was not merged: It keeps that result separate from a verified solution and uses a medium confidence label.

When no relevant history exists: It reports that there is no historical memory available and recommends investigating from first principles. The confidence label is low.

This behavior is useful because the application does not need to invent a previous solution when memory has none.

The confidence labels are heuristic categories produced by the current implementation. They are not calibrated statistical probabilities, and a high label does not prove that a historical fix will solve a different failure.

Step 4: A concrete before-and-after example

Consider an illustrative "PaymentIntegrationTest" failure:

FAILED PaymentIntegrationTest
Error: timeout after 30s waiting for payment gateway mock

Before using historical context

A developer might ask an assistant to diagnose the timeout. It could suggest increasing the timeout, checking network connectivity, or reviewing the mock service.

Those are possible debugging directions, but they do not account for what the team already tried.

After retrieving historical investigations

Suppose Hindsight returns two related records:

A previous attempt to increase the timeout was marked "failed".

A different approach that reset mock state between tests was marked "verified".

FlakeTrail can now distinguish the two outcomes. It can surface the failed workaround as something to avoid repeating and highlight the previously verified approach for review.

The developer still has to inspect the current test, decide whether the historical fix applies, and run CI. The memory provides a better starting point, not an automatic answer.

Step 5: Keep reasoning separate from memory retrieval

Another design decision is to keep the reasoning layer separate from Hindsight.

Hindsight retrieves relevant investigation records. The reasoning module interprets the records and produces structured fields such as:

Failure summary.

Possible causes and supporting evidence.

Relevant historical incidents.

Failed approaches.

Verified approaches.

Recommended steps.

Confidence label and uncertainty explanation.

This separation makes the application easier to test. The reasoning function can be tested with known inputs without requiring a live Hindsight request each time.

The project also contains a separate LLM integration layer with provider adapters for OpenRouter, Gemini, and Cloudflare Workers AI, plus an orchestrator. However, an important implementation detail in the current branch is that the normal "/api/analyze" route calls the status-based "analyzeFailure()" function directly. The LLM orchestrator is not yet wired into that main analysis path.

That distinction matters. The current recommendations come from explicit TypeScript rules using the retrieved investigation statuses; they should not be described as free-form LLM-generated root-cause reasoning.

What the tests check

The reasoning tests cover three important situations:

No historical memory: the analysis reports no relevant history, uses low confidence, and still provides next steps.

A verified historical approach: the analysis identifies the verified fix and uses a high confidence label.

A failed historical approach: the analysis identifies the failed approach so it can be surfaced to the developer.

These tests help ensure that different investigation outcomes lead to different response behavior.

They do not prove that every recommendation is correct for every real CI failure. They verify that the current decision rules behave as expected for the supplied test cases.

What still needs improvement

Historical similarity is not the same as causal proof. Two tests can produce similar stack traces for different reasons. A verified fix from one environment might not apply to another.

The current reasoning implementation also uses relatively simple rules. It prioritizes available verified records, failed attempts, and passed-but-unmerged records. It does not independently establish a root cause through deep analysis of source code or a complete execution trace.

The separate LLM provider architecture offers a foundation for more flexible reasoning, but it needs to be connected to the primary analysis flow and tested with clear evidence requirements before it can be described as the active recommendation engine.

A stronger future version should make each recommendation traceable to specific historical records and current log evidence, distinguish similarity from confirmed cause, and explicitly state when the available context is insufficient.

The lesson

The useful part of memory is not simply finding an old error. It is understanding what the team learned from the previous investigation.

Hindsight gives FlakeTrail access to historical investigation records. The reasoning layer uses their outcomes to distinguish failed attempts from verified approaches and to explain when the evidence is incomplete.

That changes the debugging question from "What fix should I try?" to something more useful:

"What happened the last time we saw something like this, and how reliable was the result?"

The project is available at "FlakeTrail on GitHub" (https://github.com/amithsharma91/FlackTrail).

Implementation references: "Reasoning module" (https://github.com/amithsharma91/FlackTrail/blob/feature/flaketrail-mvp/backend/src/reasoning/index.ts) · "Reasoning tests" (https://github.com/amithsharma91/FlackTrail/blob/feature/flaketrail-mvp/tests/reasoning.test.ts) · "Hindsight service" (https://github.com/amithsharma91/FlackTrail/blob/feature/flaketrail-mvp/backend/src/hindsight/service.ts) · "LLM orchestrator" (https://github.com/amithsharma91/FlackTrail/blob/feature/flaketrail-mvp/backend/src/llm/orchestrator.ts)

A useful debugging assistant should not just produce another possible fix. It should help developers understand which evidence supports the next step.
