Limitations of Traditional Methods

For years, businesses have relied on methods such as custom regular expressions (regex) and keyword matching. While these techniques can be effective for simpler tasks, they suffer from significant drawbacks when applied to large, evolving datasets. Regex rules are often brittle and prone to breaking when encountering variations in real-world data. Maintaining these rules becomes a complex and time-consuming endeavor, especially as the underlying classification needs or data sources change.

Basic machine learning classifiers, while an improvement, also face hurdles. The process of training these models often requires substantial amounts of labeled data. For massive taxonomies, obtaining sufficient and balanced ground truth data, particularly for rare labels, can be a significant bottleneck, leading to models that struggle with accuracy.

The LLM Dilemma

More recently, large language models (LLMs) have emerged as powerful tools for various natural language processing tasks, including classification. However, when faced with the sheer volume of labels in a massive taxonomy, LLMs encounter limitations. Their context windows, the amount of information they can process at once, can be easily exceeded when attempting to pass the entire label set. This often leads to incomplete processing or, worse, the generation of inaccurate or fabricated labels (hallucinations). Furthermore, the computational cost of sending every document and the entire taxonomy to a frontier LLM for processing can become prohibitively expensive for high-volume production workloads.

Databricks AI Classify: A Hybrid Approach

Databricks addresses these challenges with a novel, two-step workflow that intelligently combines the strengths of vector search and AI functions. This hybrid solution is designed to overcome the limitations of both traditional methods and standalone LLMs, providing a more accurate and cost-effective alternative.

Step 1: Vector Search for Candidate Identification

The process begins with vector search. Both the input document and each potential label within the taxonomy are embedded into vector representations. Databricks utilizes models like Qwen3-Embedding-8B for this purpose. By converting text into numerical vectors, the system can then perform semantic and lexical comparisons. This allows for the efficient identification of a shortlist of candidate labels that are most semantically similar to the document. This initial step significantly reduces the number of labels that need to be evaluated by more computationally intensive AI models.

Step 2: AI Classification on a Reduced Set

Once a shortlist of promising candidate labels is generated, the Databricks AI Classify function is applied. Crucially, this AI function only operates on this narrowed-down selection of labels, rather than the entire taxonomy. This focused application dramatically improves the accuracy of the classification by allowing the AI model to concentrate on the most relevant possibilities. Simultaneously, it leads to a substantial reduction in computational resources required, thereby lowering the cost per document classified.

Performance and Cost Benefits: Benchmarking Results

To validate the effectiveness of the AI Classify workflow, Databricks conducted benchmarking tests across three diverse datasets: Transactions, Companies, and MedMentions. The results clearly demonstrated the superiority of the Databricks approach over direct LLM calls and other methods.

The AI Classify workflow consistently achieved higher accuracy, with an average score of 0.81. This outperformed the next-best model, Gemini 3.5 Flash, which scored an average of 0.76. Perhaps even more striking was the cost efficiency. The Databricks solution operated at approximately one-hundredth of the per-document cost compared to direct LLM processing.

Vector search alone, while highly cost-efficient, showed a significant drop in accuracy, scoring over twenty points below the hybrid AI Classify approach. This highlights the necessity of the AI function for achieving high precision, while vector search provides the essential scalability and initial filtering.

Scalability and Maintainability for Production Environments

The combined vector search and AI Classify workflow offers a robust and practical solution for organizations that need to scale their document classification capabilities to handle massive label sets. It strikes a crucial balance between accuracy, cost-effectiveness, and ease of maintenance, making it ideal for deployment in production environments.

One of the key advantages of this approach is its inherent maintainability. When taxonomies evolve—new labels are added, or old ones are retired—they can be seamlessly updated. New labels can be embedded, and retired ones removed from consideration, without the need for extensive model retraining or complex redeployment processes.
